Online Learning with Continuous Variations: Dynamic Regret and Reductions

We study the dynamic regret of a new class of online learning problems, in which the gradient of the loss function changes continuously across rounds with respect to the learner's decisions. This setup is motivated by the use of online learning as a tool to analyze the performance of iterative algorithms. Our goal is to identify interpretable dynamic regret rates that explicitly consider the loss variations as consequences of the learner's decisions as opposed to external constraints. We show that achieving sublinear dynamic regret in general is equivalent to solving certain variational inequalities, equilibrium problems, and fixed-point problems. Leveraging this identification, we present necessary and sufficient conditions for the existence of efficient algorithms that achieve sublinear dynamic regret. Furthermore, we show a reduction from dynamic regret to both static regret and convergence rate to equilibriums in the aforementioned problems, which allows us to analyze the dynamic regret of many existing learning algorithms in few steps.

Learning online is contrasted with the opportunities a physical classroom environment has to demonstrate concepts using all five senses: for instance the color, smell and touch of a flower, the sliminess of a mollusk, the acrid smell of ammonia. The senses play an integral role in learning โ one can go so far as to say that from an evolutionary standpoint it is their sole function; we learn through experience best, and the more vivid that experience is, the deeper the learning and retention. Developmental psychology literature (both popular and academic) agrees that external stimuli โ particularly in children โ grow neural pathways, and exaggerate and enhance learning. Young children have a surfeit of neuroglial cells, and the credo "use it or lose it" applies โ neural cells and pathways not used in discovery and learning new things eventually degenerate and die. The most prevalent example is the relative ease with which young children can learn new languages, compared with when they get older.

Improving Latent User Models in Online Social Media

Modern social platforms are characterized by the presence of rich user-behavior data associated with the publication, sharing and consumption of textual content. Users interact with content and with each other in a complex and dynamic social environment while simultaneously evolving over time. In order to effectively characterize users and predict their future behavior in such a setting, it is necessary to overcome several challenges. Content heterogeneity and temporal inconsistency of behavior data result in severe sparsity at the user level. In this paper, we propose a novel mutual-enhancement framework to simultaneously partition and learn latent activity profiles of users. We propose a flexible user partitioning approach to effectively discover rare behaviors and tackle user-level sparsity. We extensively evaluate the proposed framework on massive datasets from real-world platforms including Q&A networks and interactive online courses (MOOCs). Our results indicate significant gains over state-of-the-art behavior models ( 15% avg ) in a varied range of tasks and our gains are further magnified for users with limited interaction data. The proposed algorithms are amenable to parallelization, scale linearly in the size of datasets, and provide flexibility to model diverse facets of user behavior.
