Active Learning with Oracle Epiphany

We present a theoretical analysis of active learning with more realistic interactions with human oracles. Previous empirical studies have shown oracles abstaining on difficult queries until accumulating enough information to make label decisions. We formalize this phenomenon with an "oracle epiphany model" and analyze active learning query complexity under such oracles for both the realizable and the agnostic cases. Our analysis shows that active learning is possible with oracle epiphany, but incurs an additional cost depending on when the epiphany happens. Our results suggest new, principled active learning approaches with realistic oracles.

Forty years ago this week, on 22 January 1984, a stunning advertising video was screened during the Super Bowl broadcast in the US. I had a couple questions I had wanted to ask Tom Siebel ever since his company, C3.ai (ticker "AI") went public in December of 2020. When I finally get my chance, I have to wait a moment, because Siebel is irrepressible. He often has the advantage on a reporter, leading with a kind of gusto that eclipses the standard question and answer protocol. "I had an epiphany this week," Siebel tells me, over a Greek coffee at a Greek joint in midtown Manhattan, Friday afternoon. Siebel, in the course of meeting with investors in New York and Boston this week, including Fidelity, has had reason to crystallize his thoughts about what artificial intelligence means, at least for his company and his customers. It is a good time to go on the road. At a recent stock price of $24.24, C3.ai shares are down sixty-five percent in the past year, twenty-two percent this year, and seventy-four percent since the IPO. And the entire software market is somewhat in the toilet as valuations are revised across the board.

My takeaway is that the concept of AutoML is good, but scope of the AutoML vision is missing 80% of the AI/ML model development and operationalization – providing high quality and complete data that feeds the AI/ML models. Figure 5 from "Big Data to Good Data: Andrew Ng Urges ML Community to Be More Data..." nicely summarizes the broader AutoML challenge with respect to data management.

In the exploding era of computing (ubiquitous, mobile, quantum or whatever suits you better) there's still a sacred Graal we struggle to reach without success, even if we look closer every Moore's law step we advance: Artificial General Intelligence (AGI). Back in 2010 or so, in my days as Bioengineering MSc at University, I had my 10 minutes epiphany. I suddenly pictured that, some day, a reinforcement learning implementation general enough on a hardware powerful and beautiful enough might have led to a so-called strong artificial intelligence or artificial general intelligence. Indeed for those who do not chew machine learning at breakfast, this may look something really cool, but moving to a more concrete reality my realization was much more pragmatic. In "traditional" Artificial Intelligence approaches, you pick for a task (the one you think it is worthy enough to be tackled) and put in place a supervised learning technique.

Why not model a thought hierarchy of the user with cumulative research and testing data?
