Implementing Custom GridSearchCV and RandomSearchCV without scikit-learn

Grid Search can be thought of as an exhaustive search for selecting a model. In Grid Search, the data scientist sets up a grid of hyperparameter values and for each combination, trains a model and scores on the testing data. In this approach, every combination of hyperparameter values is tried which can be very inefficient. For example, searching 20 different parameter values for each of 4 parameters will require 160,000 trials of cross-validation. This equates to 1,600,000 model fits and 1,600,000 predictions if 10-fold cross validation is used.

In computer vision, we often build Convolution neural networks for different problems dealing with images like image classification, object detection, etc. In image classification tasks a CNN network is built using a combination of different convolution layers, pooling layers, dropouts, and at last fully connected layers. But while building this type of networks we define different sizes of kernels to extract feature maps and different neurons for different layers. We do not have a fixed rule of defining the number of layers, neurons, and kernel size. Keras Tuner is a library that resolves this problem and gives us the optimal parameters to attain high accuracy.

Optuna: An Automatic Hyperparameter Optimization Framework Open Data Science Conference

Preferred Networks has released a beta version of an open-source, automatic hyperparameter optimization framework called Optuna. In this blog, we will introduce the motivation behind the development of Optuna as well as its features. A hyperparameter is a parameter to control how a machine learning algorithm behaves. In deep learning, the learning rate, batch size, and number of training iterations are hyperparameters. Hyperparameters also include the numbers of neural network layers and channels.


Using Known Information to Accelerate HyperParameters Optimization Based on SMBO

Automl is the key technology for machine learning problem. Current state of art hyperparameter optimization methods are based on traditional black-box optimization methods like SMBO (SMAC, TPE). The objective function of black-box optimization is non-smooth, or time-consuming to evaluate, or in some way noisy. Recent years, many researchers offered the work about the properties of hyperparameters. However, traditional hyperparameter optimization methods do not take those information into consideration. In this paper, we use gradient information and machine learning model analysis information to accelerate traditional hyperparameter optimization methods SMBO. In our L2 norm experiments, our method yielded state-of-the-art performance, and in many cases outperformed the previous best configuration approach.
